How can you make machine learning projects more transparent and reproducible?

Using version control like Git not only preserves different versions of the work but creates a history that reflects the thought process and evolution of a project. I’ve seen how vital this can be, not only for collaboration but also for on-boarding new team members. It helps in providing insights into the decisions that shaped the project.

Version control is like a time machine for your projects. It's reassuring to know that if you make a mistake or want to revisit an old idea, you can easily jump back to a previous state. Think of it as a safety net for your code and data, where every change is documented and nothing is ever truly lost. It's especially helpful when working in teams, ensuring everyone is on the same page.

Using Version Control is a great way to track code changes over time. Also, one should use model tracking tools like weights and biases, MLFlow, etc.. Also, one should write code which is function/ class based, which can be reused across different projects.

Through my experience in MNC's I think maintaining detailed documentation with visuals which can be easily accessible & ofcourse, version control with trackable history would be convenient.

It's important to mentor new and junior members of the team about version control principles, and make it part of daily workflows.

Documentation is one of the ignored steps, everyone loves to code but no one is interested in documenting the steps. I have seen technologies given least preference, just because they don't have good documentation.

Documentation is king! I've been part of so many projects where we went through a lot of experiments very quickly, only to realize at a later point that we couldn't reproduce most of them due to lack of documentation. The problem is that documentation is only considered important in the endgame, and not a crucial component of experimentation.

Documentation that is concise makes it easy to understand the point to which the documentation refers. Also, just like one should avoid "distributing" functionalities among various functions, one should avoid "distributing" documentation when it is not necessary. The best practice is to present "the big story" in the beginning of a function, and give concise explanation in the body of the function as operation are performed.

MLOps is a set of practices that help to automate the ML lifecycle, from data collection and preparation to model training and deployment. By applying MLOps, organizations can reduce human effort and improve the performance of their ML projects. Version control, Documentation, Continuous integration and continuous delivery (CI/CD), Model monitoring are key actions. MLOps can help organizations reduce human effort, improve the performance of their ML projects, and get more value from their data. Like DevOps now MLOPs also taking the important place.

By automation, we can increase the chances of ML projects to stand out from Jupyter Notebooks and actually deploy and can make available to the users. Things we can consider for automating the process are in following areas - 1. Data Ingestion - Automate data input and processing pipeline by using tools like airflow. 2. Model training - Automate model training by using framework like MLFlow where model can be trained automatically on new data and versioning is also been taken care. 3. Model Deployment - Deployment is cumbersome process if it is not automated. we can use tools like MLFlow and Kubeflow.

Running code block by block in isolated Jupyter notebooks is fine for very early stage experimentation, but the sooner you get to the stage where you can run ten different variations of your experiment just by passing ten different sets of your parameters, sooner you'll start seeing a treasure trove of results.

Make sure to house your models in an appropriate model registry, and make use of tools like MLflow for experiment monitoring. Containerizing Scripts and Freezing Data Containerizing code and moving hyperparameters out into configuration files helps recreating the results. There are a lot of sources of randomness in the training pipeline. If hyperparameters (including random seeds) are moved out to a configuration file, it gives users more control over the training process and make it more likely that the results will be reproducible. Containerizing code make it easy to run the entire pipeline and ensures that the training environment is fixed. Finally sharing the code and data checkpoints helps identify any bugs with the code and/or problems with data.
