How do you validate a self-driving car's computer vision system?

Before start talking on HOW to do what if we start on WHAT first? There are many of analysis, like risks, safety, failures, requirements, dependencies, connections, quality, etc, which the data will be directly related to. The quality of your data will vary according to your boundaries and environment you submit your system, and these one's are dependent of your analysis. And your results and conclusions can be far from the ideal if you define a wrong concept of your data acquisition and for the automation.

It is crucial to consider photos taken in high speed conditions. Because obstacles might not seem very clear while camera takes the photo of them in high speeds. We should make sure that our model is also able to detect the obstacles, people, traffic lights, etc. in the non-perfectly-clear conditions as well. One way of preventing it is to add some non-clear image samples of obstacles in the training data and “teach” the model how to treat such obstacles.

The data should be diverse, covering various scenarios encountered on the road. It's essential to have a well-annotated dataset, making sure the annotations are accurate. Additionally, data privacy and security need consideration, ensuring that any data used complies with local laws and regulations. Lastly, continuously updating the dataset to include new scenarios and conditions is vital to maintain the system's robustness over time.

Do not train and test on the same track. Two blunders that can happen: - Sampling your frames randomly across the temporal dimension - Using footage from one day in your train set and another day from the same route as your test set. Having them be from a similar distribution is acceptable and somewhat desirable. As part of validation: Look into simulators which can be used for validation. Good thing about simulators is to use different lighting , weather and traffic set up. The simulators put the algorithm at a lower risk of damage. If the car passes simulators they can be validated on controlled conditions (Such as track etc) which can show reliable measure. Once a car passes both these tests , they can be used on real world scenario under supervision for better reliability and functionality.

Fidelity is a major issue here. Right now , simulation will always be slightly different from real-life situation. How do we make sure that the results we get from simulation are transferrable to the real world?

Continuous improvement in vision for self driving requires a full loop from information collection in the vehicle, upload to the cloud, training data management, training, validation and simulation and deployment back through OTA. For final validation, the vehicles might have to have enough computing power in order to run the new version in "shadow-mode" in order to compare the performance of old vs. new in the field.

Here are some other ways in my opinion to validate self driving cars, 1. Object Detection & Calibration : Cameras on cars can provision continuous feedback to humans sitting in offices to provision continuous Supervised learning through active testing. Cars tested in closed circuits without traffic can use this method prior to running on public or private roads. The more the models learn through continuous supervised learning testing, the improved they can perform. 2. Mapping and Re-Projection - Object detections in sensor modalities and camera-Lidar calibration can provision the foundation for the fusion of sensor data. This fusion of sensor modalities using object detection matching, can enable information testing of self driving cars.

Use them, gaze at your metrics remotely, compare them, it's 2023. To improve your solution, you need a baseline with metrics on your representative benchmark(s), no concessions. Your decisions should be data-driven and not just like "well, it found enough cones on those ten images". Make them quantifiable and easily comparable. If you run dozens/hundreds of experiments, have a way to come up with the top-K models to inspect them in detail. Sometimes, benchmarks get saturated. If you come up with new ones, evaluate your legacy models on them as a sanity check, too.

Testing a CV system is much more than the basic accuracy of the models. The whole system is expected to run on fpga boards so each component must be tested for accuracy after conversion and of course for speed. Typical CV models and algorithms may require adaptation for specific HW, and each manufacturer will make their own conversions. Specifically, an algorithm or a model will be optimized for that specific HW on which they will eventually run, which may open new challenges in terms of data acquisition or accuracy concerns. In summary, consider where and how the model will be run and test it accordingly.
