What are the benefits of using artificial intelligence to improve root cause analysis in quality improvement?

I agree AI can help in analysing vast amount of data to identify the correlation very easily and very fast than humans, but it do need human intervention at early stage. Later AI can learn and adapt over time, improving the accuracy of root cause identification.

Given a sufficient sample size of quantitative data over extended periods of time AI systems will provide automated, instant RCA in manufacturing. This will be accomplished, in my opinion using a 2 pronged approach. First, computer vision automated 100% inspection systems identify quality defects immediately. The vision algorithms then communicate defect dimensions to A.I. learning systems which reference possibly hundreds of thousands of scenarios and their corresponding root causes instantaneously, and providing accompanying solutions. The systems will eventually be integrated into production machinery able to automatically make offsets, program edits even mechanical tool changes to achieve conformity based on its own RCA results.

The concept of AI is to work by combining data sets (big data) with computer science. AI will absorb a fairly large amount of labeled training data and then analyze it to identify pattern recognition. So with the first step we can collect various data and patterns related to problems that have occurred, as well as theories related to RCA, so that AI can teach well according to the problem cases faced by taking a solution approach based on the data that we teach into this AI system.

AI in RCA will provide a fast & better way to go to the root cause, reduce downtime in providing end solutions. It will have a more structured approach in problem solving rather than bypassing some of the key points which is sometimes done in traditional method to reduce the overall time.

I believe that AI can help once there is a large data set to interpret what is happening. I can see AI recommending fixes before they become larger issues; however, RCA on catastrophic issues will continue to need personnel involvement. AI may speed up testing, analysis, and improve things like DOE’s, but issues hopefully are abnormalities in the process which make them hard for AI to process.

Implementing AI for manufacturing requires sensors, which is an added cost. Those machines with IOT inbuild shall save the cost, and the latest one IOT 3 or 4 connects to the network and helps a lot to collect the data. Using AI for RCA also opens up Reliability Engineering in manufacturing. An important aspect of implementation is the cost and the time-saving.

Root causes can be hard to identify through theoretical analysis alone, even if done by AI. Only when the mitigation of a hypotethical root cause is tested in practice, do we learn enough to have a resilient root cause. I. E. - AI cannot find the root cause alone, only guide human minds along to better learning.

The limitations of AI in the root cause analysis process include: 1. Data Dependence- - AI heavily relies on the quality and quantity of data. Insufficient or biased data can lead to inaccurate or incomplete root cause analysis. 2. Interpretability and Explainability- - AI models, particularly deep learning models, are often considered "black boxes" that provide results without clear explanations. Understanding the reasoning behind AI-generated insights can be challenging. 3. Lack of Domain Knowledge- - AI may not possess domain-specific expertise or contextual understanding. It relies on data patterns, which may not always align with domain-specific nuances and expert knowledge.

Well, in my experience I have seen that data collection is the toughest part of any manufacturing facility. The main reason for this is most machines are not IOT enabled or have many old CNC controllers these variables/data can be obtained with the OEM of the machine, which becomes more costly and time-consuming. After all these, the high-cost factor makes many manufacturing facilities have second thoughts about having an IOT-enabled machine and implementing an AI model. But for a large number of stages in manufacturing, it's advisable to use these technologies. Many talk about AI, but the basic reality is that many of the designs are still being made in Autocad rather than 3D CAD software.

Three key areas when using AI for RCA: - user training - make sure that the people who are setting things up and providing inputs know and understand how things are used to get the best quality output. - context - ensure that the AI is provided with the full context of the situation, e.g. is the product hardware/software, mechanical/electronic. This can be related to user training or it can be hard-coded into the AI. - review outputs - AIs are not infallible and having a domain expert review outputs is usually necessary, unless the process is run mutliple times and/or the impact of errors is low.

Using AI as a tool, like other tools and incorporating it where vast data sources are available. Anything that is automated should have historical data stored so that AI can learn from it once implemented. A standard for the company should also be created that makes sure that AI is not used in areas where data is lacking. You don’t want AI trying to fix a brand new line when consistent parts have not been made.

People using AI for RCA will not require the user to go to the problem site, effective Gemba & understanding the problem may lead to the wrong RCA. Further problem solving end to end time would increase.

Very little IMHO. AI may help to populate the fault-tree, but it does not walk to the shop to talk to machinist, mechanic, users or people that is concerned. It may provide engineering solution, example, heavy Cover of a storage box slammed onto someone's hand.... install pneumatic dampener to slow the closing motion. .... the better solution probably is to remove that cover. Burning cigarette, Oxygen, combustible material create fire. We can't remove Oxygen, hard to stop people from smoking, then restrict the smokers to a corner where no combustible material around.

AI is only as good as the inputs and it doesn't read what is in people's heads. One of the biggest issues in a manufacturing environment is tribal knowledge and it is difficult for this to be drawn out of a human brain when the human is question may not even be aware it is an issue. There's always a chance that people are keeping things to themselves for self-preservation, but if you don't know what you do instinctively without conscious thought, you can't be blamed for not openly sharing it with someone else. This type of issue can be picked up in theory by machine learning, but then how can we be sure it's actively being done from a process perspective?

One area that would be good for AI implementation of RCA is in the prevention side. This way all new designs or modifications for designs could go through the AI to make sure that a design issue previously fixed is not reintroduced.

The biggest challenge for AI to be used along with RCA in manufacturing is the accumulation of lessons learned, NCR and data. I have seen organizations where documents are available but data manipulations are not performed. It is like, we know we make defects or errors but we don't know what error contributes and creates how much impact on the production process. Even in many facilities, the RCA for any defect or error can be a new contributing factor, when AI is used, the new contributing factor to be ascertained by AI is a matter of training and experience the AI model has attained.
