What challenges do computer vision algorithms face in real-time applications?

For traditional computer vision measurement tasks, the key lesson I have very much learned the hard way is that you need to control the environment as much as possible. In particular, the lighting conditions. You can save yourself hundreds of hours of algorithm development time by simply engineering the system to control the environment you are capturing the images.

To improve accuracy and robustness in computer vision algorithms, there are several tips and techniques that can be used. One way is to preprocess the images before feeding them to the algorithm. This can include steps such as enhancing the image quality and reducing noise. Another way is to improve the model itself by running experiments & analyzing its results. This can involve gathering data about the model's behavior & changing it accordingly to make it more accurate, robust, or efficient at solving a particular problem. Parallelization techniques such as multi-threading, multi-processing, or GPU acceleration can also be used to improve the performance of computer vision algorithms.

Computer vision faces crucial challenges in real-time applications, focusing on achieving a delicate balance between accuracy and speed, crucial for tasks like object detection and autonomous vehicles. Scalability is vital to handle growing data volumes efficiently. Safeguarding privacy when processing visual data remains a pressing concern, demanding robust methods to protect sensitive information. In things like video calls or games, we want both speed (to get things done fast) and low latency (so there's no annoying delay). Speed and latencies are the biggest issues along with GPU and CPU power of the machine to run the application or deployed model or even on Cloud labs as storage problems intervene with speed and runtime.

Deeplearning Models are generally considered as bottleneck as they require most compute. Speed and latency can be greatly improved if models are optimised prior to deployment. For CPU/Mobile CPU based deployment consider converting the model to ONNX. For NVIDIA GPU based deployment consider model conversion using Nvidia TensorRT.

Both speed and latency are often influenced by the trade-off between accuracy and computational demand. More complex and accurate algorithms typically require more processing power and time, which can slow down the system and increase latency. One thing I have found helpful is that we can reuse same model for doing same task on data from different modalities or devices. Trick is in being able to to find correct preprocessing techniques to transform data from different modality in such way that transformed data have similar distribution of values to the training data. This increases adaptability as it unlocks new modalities/data sources while being cheaper alternative to retraining model and assembling new training dataset.

In a traffic monitoring system as an example, the scalability and adaptability in real-time computer vision will be as follows: Scalability Example: This system processes visual data from multiple cameras across a city to monitor traffic flow. As the city expands and more cameras are added, the system scales to handle the increased data volume, analyzing traffic patterns and detecting incidents without performance loss. It adjusts its analysis and recommendations based on these changing conditions, ensuring accurate traffic management.
