What are the most common decision tree challenges and how can you overcome them?

In my experience the most common issue in visualizing data is data quality. Decision trees aren't an exception to this and few things that you might want to check are: missing data, outliers, categorical variables, imbalanced data, overfitting, noise and small sample sizes. If you notice problems with these topics take the appropriate data cleaning and processing steps.

During my experience in Audit & Compliance, I realized that the most important thing before starting any analysis is to verify your data quality and data reliability. Tips: Tip 0: Verify that the data set you have is pertinent to the decision tree you need to assess. Tip 1: Check the completeness of the data set. Tip 2: Perform random checks to verify the accuracy of the data set. Tip 3: Ensure that the data set is well-structured and correctly titled (e.g., headers and legends) to be clear to anyone who uses it.

To overcome this, prune the tree by setting limits on depth and minimum samples per leaf, or use cross-validation for optimal parameters. Another challenge is handling missing data, which can be addressed by imputing values or using algorithms that can handle such gaps. Bias towards dominant classes is also a concern; balancing the dataset or using algorithms like weighted decision trees can mitigate this. Finally, dealing with non-linear relationships can be challenging, but combining decision trees into ensembles like random forests or gradient boosting can help capture more complex patterns.

Not just for decision tree models, but also for all of the ML algorithms, ensuring the data quality is the first step to have a strong ML model. If that is not the case, then you are building a house on a moving ground. No matter how fancy it looks, it would probably collapse at the end. To prevent that situation, asking questions on your data source, cleaning and validating your data are so important.

This makes them not work as well when applied in the real world. We can simplify overly complex trees. 2. Poor Quality Data Errors or missing information in the training data used can cause issues. We have to fix problems in the data first before using it to train the decision tree. 3. Complicated Rules Sometimes, the rules in a decision tree get overly intricate and complex. Simplifying very complicated trees makes them easier to interpret and apply in practice. To solve these issues, 1. Simplify overfit trees 2. Clean up poor-quality training data 3. Reduce the complexity of rules

A complex tree has a lot of branches, nodes, and splits, making it hard to understand and explain. Moreover, complexity can pave the way for overfitting, where the tree excels on training data but fails on new or unseen data. To surmount this obstacle, employing pruning techniques might be helpful. Also, creating a simple model instead of complex model would also be helpful. To do that feature engineering is essential.

Instead of thinking of this as a challenge or a limitation, we have at times used decision trees as the first-step exploratory tool to identify non-linear relationships and interactions that otherwise might have been missed by our linear models. So yes, a change in perspective can may be lead you to a more informed & sophisticated analysis in the long run.

In my experience, one of the most frustrating limitations of decision trees is that not all answers have equal weight or importance. Following a Yes/No may lead us to a decision of YES-do this, when one NO should have stopped the whole project.
