What is a reliable way to measure the ROI of deploying a machine learning model?

The only rigorous way to do this which most Data Scientists aren’t trained in falls within the realms of Decision theory. One way is to consider what business decision you need to make. Define this variable as anintervention you have control over with a policy (like in RL). You want to learn the optimal policy for this variable. You do this by maximising your utility. Now consider what variables along with your decision variable impact your utility. Assume your decision doesn’t impact these variables else problem is a little trickier. We can build ML models to directly predict the values of these variables thereby changing our decision policy. By changing your policy you can directly tap into what is known as value of information.

In an ideal scenario, before starting with a Machine learning model, the KPIs pertaining to the business problem must be clearly defined and agreed upon with key stakeholders. The KPIs should ideally be measurable business KPIs. Additionally, a detailed cost estimate (People + technology) should be done and agreed with key stakeholders. Post development of model, before deployment, a simulation based A/B testing experiment can be run to evaluate and compare the pre vs. post performance of the business KPIs. Once this passes the litmus test, the same experiment along with feedback, can be run post deployment. Finally, a field based A/B testing can be designed and run periodically to compliment the simulation experiment and arrive at the ROI.

Defining the objective is the most important aspect of any project. It becomes extremely important in ML projects. Due to the current hype of AI, companies can start projects which can be classified as "AI for the sake of AI". To escape this it is important to follow these steps: 1. E.g. once I needed to deploy a model that continuously stack-ranked a queue based on a classification probability. The challenge was that there was no clean way to A/B test this since we couldn't deploy two different queues.
