It is a good idea to spend a week or two scouting and learning more about what is already being offered by the open-source community surrounding a business problem. They often contain hidden gems that lead to new solutions for old problems. And, on the contrary, they also give a strong perspective on why a problem shouldn't be pursued at all. Seeking inspiration is a good routine-based practise for digging out innovation.

To stay ahead of the competition using machine learning, start by identifying your business problem. Determine specific challenges or opportunities where machine learning can make a significant impact, such as optimizing processes, improving customer experiences, or enhancing decision-making. Conduct a thorough analysis of your data assets, identifying valuable insights and patterns that can be leveraged to address the business problem effectively. Then, explore ml techniques and algorithms tailored to your problem domain, selecting the most suitable approach to develop innovative solutions. By focusing on solving real business problems with machine learning, you can gain a competitive edge and drive sustainable growth and success.

To get ahead with machine learning, first, figure out exactly what you're trying to fix or improve in your business. Is it about selling more, spending less, making your products better, or maybe making your customers happier? Once you've got that clear in your head, you can pick the right machine-learning tricks to tackle your problem. Think about how you'll know if you're successful, like making more money, getting things right more often, or having happier customers. This step is all about making sure your effort in machine learning really hits the mark and makes a difference where it counts.

Start by identifying the problem. Next, research how others are addressing similar issues. If data is available and machine learning could be beneficial, begin gathering data. You can also use available models or code as a starting point. This approach can help you to use less data by applying transfer learning in machine learning, which can speed up the process. After testing and confirming the solution's effectiveness, you can then allocate more resources for collecting additional data, doing further research, and developing more sophisticated models and solutions.

Very right beginning to stepping into AI driven business. AI can assist in making the most out of many business areas. But a paradigm shift is required. Business leaders and technology leaders need to collaborate and strategize. 1. AI is never 100% perfect. 2. Still if it is even 70% it can help out of 70% times, which is not bad. 3. AI is not to replace humans, but is a prosthetic to support humans to do better. 4. AI has cost involved, need to evaluate. Even if there is no good ROI as of today but how capable it is also making the business to adapt and scale with the changing world. 5. Also, do not try to fit AI on just a step, but think of a holistic solution My purpose is not to advocate AI, but open up approach to it.

My rule of thumb is to spend 80% of you time cleaning and studying your dataset and your evaluation methods and 20% on your algorithms and modeling approach. Try to use various ways to dive in the datasets, from various angles. Some manual inspection, some automated clustering. Always inspect what you've filtered and what remains. Most datasets cover several sub-parts. Make sure each independant sub-parts is correctly cleaned and taken care of.

Effective data collection and preparation are essential for building robust and accurate ML models that deliver meaningful insights and value to your business.

In our endeavor at the startup to stay ahead in the market, we meticulously followed a data-centric strategy: Data Gathering: Pulled from varied sources like web analytics, social platforms, IoT sensors, and internal databases to ensure a rich data pool. Data Cleaning: Undertook rigorous cleaning processes, eliminating inconsistencies like duplicates, outliers, and missing values that could skew our ML model's accuracy. Data Transformation: Applied normalization and encoding techniques to ensure our data was in a uniform format, enhancing our model's learning efficiency. Data Labeling: For supervised learning models, we meticulously labeled our data, providing clear signals for our algorithms to learn from.

Gathering data is akin to embarking on a treasure hunt. You explore various sources—social media, databases, sensors—searching for the most relevant and diverse data. This diversity is key, as it shapes the insights your models will generate. However, the true skill lies in refining your findings. You meticulously clean the data, removing outliers and duplicates, and then carefully normalize and encode it. This isn't just about following steps; it's an art. By personalizing this process to fit your project's unique needs, you transform raw data into a treasure trove of wisdom. The goal is to ensure your models are not just processing information but extracting meaningful, actionable insights.

Once you've identified the problem, focus on gathering relevant data that can provide insights into addressing it. This data could include customer interactions, sales trends, market dynamics, and competitor information. Ensure that the data collected is comprehensive, accurate, and well-organized to facilitate effective analysis.

When picking and training your machine learning model, it's about more than just processing data. Think about how your model will grow with you. As your data changes, your model should too, so keeping track of versions and how they perform over time is a big deal. Also, choosing between a super complex model and one that's easier to explain can make a difference, especially in areas where you need to show your homework, like in finance or healthcare. And let's not forget about the practical stuff: making sure your model plays nice with your current tech and is cost-effective to operate. Going for a model that's not just smart but also practical means you're set not just for today but for the long-term journey.

You need to, when selecting and training your ML model, ensure that it is interpretable and explainable. This is important especially in domains like finance or healthcare. In these, you need to justify decisions quite clearly. Be careful. It may be tricky to determine the right balance of your model complexity and transparency.

At our startup, navigating through the ML landscape involved a structured approach: Model Selection: Based on our specific challenge—be it enhancing customer engagement or optimizing logistics—we chose an appropriate ML model. Regression models illuminated trends, while classification models aided in customer segmentation. Framework Utilization: Leveraged TensorFlow and PyTorch for their extensive libraries, simplifying the model building and training process. Performance Evaluation: Metrics like accuracy and precision were pivotal in assessing model effectiveness. It wasn't just about high numbers but ensuring the model's predictions were meaningful and actionable.

Based on the nature of your business problem, select an appropriate machine learning model. Training the model involves feeding it your prepared data and adjusting parameters to optimize performance.

Be very careful about your evaluations and make sure they stay relevant over time. Don't hesitate to progressively increase the amount of aspect you're evaluating. Like testing in software, a monitoring suite should progressively increase in size to cover more and more of the utilisation spectrum.

Continuous monitoring is key to quickly identifying any issues or areas for improvement. This stage often involves A/B testing to compare the ML model's decisions against existing strategies.

Many people associate continuous monitoring of ML models primarily with tracking performance metrics like accuracy and model drift. However, it’s equally crucial to monitor additional metrics, including cost and latency.

When deploying and monitoring ML models, streamline the process with CI/CD pipelines for automatic updates and use version control for models and data. Monitor performance using metrics like accuracy and business-specific KPIs, and set up real-time monitoring for immediate issue detection. Implement feedback loops from users for continuous improvement and plan regular retraining with new data to keep the model up-to-date. Have backup strategies ready for any downtime or failures. Lastly, keep an eye on ethical and legal implications to address potential biases or privacy concerns. These steps ensure your models are efficient, relevant, and responsible, providing lasting value.

During my tenure at the startup, deploying and monitoring ML models was pivotal: Cloud Deployment: Utilized AWS for its scalability and reliability, seamlessly integrating our ML models into our service infrastructure. Ongoing Monitoring: Established robust monitoring mechanisms to track model performance, ensuring consistency and accuracy in predictions. Iterative Updates: Regular updates and retraining sessions were scheduled, adapting to new data trends and feedback, keeping our models at peak performance. Stakeholder Feedback: Actively sought insights from users and stakeholders, using their feedback to refine and enhance model functionality.

Machine learning is an iterative process. Use the insights gained from deploying and monitoring your model to refine your approach. Feedback loops can help in retraining your model with new data, further enhancing its accuracy and reliability.

Rather stuck to old school style ML algorithm, there is so many research paper popup everyday. e.g. xLSTM has been replace by LSTM. There is no more requirements for train model for cats and dogs, which is replace by zero-shot vision embedding models. Constant flow of innovation is pop up every day, so knowledge management is key to success.

You, yourself, learn and improve from ML. Take a proactive attitude. Don't just try to keep up with the competition. It's like keeping up with the Joneses. Beat your competition by fostering a strongly data-driven culture within your organization. You can probably do this best by promoting collaboration among the stakeholders and data scientists. Also the ML engineers. Tear down the silos! Heavily promote the sharing of knowledge. (That's why I like open source!)

If you're just now asking this, you're already behind in using ML to keep up with the competition, and they're likely already working on it. The fastest path to catch up would be with the help of your account team at your cloud provider. At least for AWS, there are lots of free resources, including help from solutions architects, if you reach out to your account team. If haven't met an account team, put in an account and billing support request, enter your use case details and expected load in production, and ask to meet with your account manager, so they can help find resources to help you accelerate.

Staying Updated: The field of machine learning is continuously evolving. Keep abreast of the latest algorithms, tools, and best practices to ensure your solutions remain cutting-edge. Ethical AI Use: As you implement machine learning solutions, consider their ethical implications to avoid biases and ensure fairness. Skill Development: Continuously upskill your team in the latest machine learning techniques to foster innovation and creativity. Competitor Analysis: Keep an eye on how your competitors are using machine learning. This can provide insights into new areas of application or highlight potential gaps in your strategy.

One other key step to consider is, build VS buy. Just because you can, doesn’t mean you should. Keeping your data science and analytic teams focused on core competencies that deliver a competitive advantage can sometimes be as easy as buying a COTS (commercial off the shelf software) solution for use cases that have well developed solutions in market.

Automate before innovate. Treat data as an asset that needs continuous maintenance instead of simply a resource. More often that not, the methodology that targets the biggest pain points and highest value are the most manual & tedious, but surprisingly simple once the domain knowledge has been attained.
