Your machine learning models are good, but how can you make them great?

Build a wall around them! Seriously now: you need to treat ML as the iterative process that it inherently is. Start out with whatever data you have. Do a decent first attempt at cleaning it, augmenting it, and feature engineering it. Train a simple model on it, and properly evaluate your results. You've got yourself a baseline! Now go back to step one. Analyze the data. Find problems in it (there will be). Correct them. Find more data. Do data augmentation to make the most of it. Do careful feature engineering, and then analyze feature importance to see what's working and what should be improved. And same goes for the modelling - improve your hyperparameter tuning scheme. Maybe pick a stronger one. Step by step, see results improve!

Given that most applied machine learning is on structured data, feature engineering is critical to take "using the right data" to the next level. Let's use a healthcare example: highly predictive characteristics of medical claims include diagnosis and procedure codes. The challenge is that when you have a patient-level outcome you are predicting, you often aggregate claims up to a single row. Therefor, each patient can have up to dozens or even hundreds of different codes without a clear way of flattening it out. That's where feature engineering comes in, and I'm not talking about one-hot encoding. When designing custom neural networks, it's essential to meticulously work on each layer, understanding the purpose and function of each. This is a simple process I've followed when approaching ML problems. 1. Do extensive EDA - scatter plot, pair plots, box plots, line chart, and the whole 9 yards. 2. The EDA should contain GROUP BY and SUM()/COUNT()/ whatever aggregation is relevant for many if not all columns. 3. This EDA will give a fair idea of what features to use. 4. Have code to create the features from input data. 5. Start with logistic regression, get a baseline accuracy that is better than the current solution. 6. Improve or try to keep the same accuracy reducing features and/or adding them. Once the feature engineering step is completed, move to random forest, then move to XGBoost

No single ML model fits all boxes - in line with the "no free lunch" paradigm in AI. Always start with simpler models (e.g. linear regression, decision trees, XGBoost etc.) before jumping to more complex models like neural nets. Remember that while you might easily get 99.9% accuracy by using neural nets, it may well be only performant on your "test data" and lack generalisation to new, unseen data. It is very easy to overfit more complex neural architectures - so if you can, try to keep it simple. Plus, simpler models are more explainable and transparent as a bonus. Never rely on one single model during development even if it's state-of-the-art- compare it with multiple other baselines. XGBoost wins most Kaggle competitions for a reason.

According to me evaluate how well each model handles cold start scenarios, especially when dealing with new users or items

That’s the best and the worst part of being in the field of Machine Learning: there’s no limit to what you can learn. The knowledge in the field of ML is like a bottomless pit, with new models, optimisation techniques, and best practices coming in almost regularly. It is good that your model is doing well, but to make it great, you need to keep yourself updated with the current trends- read research articles from good journals and read PoCs from platforms like arXiv. This is actually very true that to keep yourself updated is crucial for so many reasons. 1. I now am a full-fledged multidimensinal array user, I hardly use 2D data for my Computer Vision projects as loading and editing them would be time consuming. I stumbled upon such datasets while reading a blogpost from one of my favourite Climate researchers out there. 2. Podcasts and newsletters help a lot as they contain elaborate contents. My current research interest is using Physics-based AI which I first came across a podcast and then went through a lot of relevant lectures. 3. One very out-there resource is streaming services, but I know a few ML practitioners streaming their coding sessions which is also a 2-way collaborative approach.

All models are wrong, but some are useful... Your ML model should be solving a particular problem. That problem has an ROI. Getting your model form 50% to 70% accuracy can cost $10k, but taking it from 75% to 76% can cost you $50k. Is it worth it? If your model gets the job done, be mindful of continue working on it, the ROI might not be there anymore.

For the longest time I had this notion that ML models should be specific to a system thus catered towards only one job. But as I grew as a professional, it hit me the better we can generalize the models the less risky it gets. If you are working with such datasets which can have temporal dynamism thus need to be calibrated or anything along those lines, better to generalize the model to be able to bear those changes overtime. 2 very different approaches would be Data Augmentation in cases of Computer Vision even when the model is running great just to be sure it is optimized. Another approach in numerical data is to integrate numerical models in the training phase to integrate universal laws such as in Physics- based ML.

A company may have 1000s of AI/ML models and microservices running. Upgrading every model (JUST BCOS V KNOW HOW TO) can lead to bankruptcy. 1)Why improve an already good model? Is it an explicit/implicit ask from the client or is there a true business case for undertaking this work(i.e. who will benefit? how much will they benefit? Will they pay us $$$ for the incremental benefit of say a higher accuracy model? If no, who will compensate us for the opportunity costs of pursuing these upgrades? Bear in mind, if nobody is not paying for that work, its coming off your investors' pockets! So ML leaders should think thru the above BEFORE putting resources (AI/ML developers and infra assets) into latest techniques to improve model performance.
